Completed diffusion refinement ablation analysis¶
This report is generated from the final machine-readable artifacts in logs/ablation-suites/refinement-rerun-20260731T130254Z/ and logs/ablation-suites/model-c-rerun-20260731T130254Z/. It covers 17 training ablations, nine Stage 2 checkpoint evaluations, the full K=10 Model C guidance sweep, and calibration diagnostics.
include_test_in_train: true was retained as requested. These are controlled comparisons, not unbiased held-out generalization estimates.
Executive conclusions¶
- Model B:
stage1_peak_onlyhas the lowest composite peak/structure score (6.62) and robust-peak MAE (5.75 m/s).stage1_peak_awareis the better compromise for high-wind MAE and peak bias. - Sampling trade-off:
stage1_peak_structure_balancedhas the best RMW error (22.35 km), but weaker peak score and more negative peak bias than the peak-only variants. - Model C training:
stage2_structured_asinhhas the best probabilistic score (4.52), but every Stage 2 variant has negative skill versus the frozen baseline. The best is -42.7%. - Model C evaluation: raw pixel-MSW MAE is best for
radial_only(10.08 m/s), while robust-peak MAE is best forpeak_only(8.51 m/s). These are different optima. - Core failure mode: the literal maximum pixel is strongly high-biased, while robust high-wind peaks are low-biased. For target winds above 60 m/s, robust-peak bias is roughly -23 to -24 m/s.
- Calibration: in-sample calibration is optimistic. Leave-one-storm-out errors remain large and interval coverage is far below nominal.
Model B / Stage 1 results¶
Lower is better for errors and the composite score. Peak bias closer to zero is better; negative values indicate underestimation.

Relative to control, stage1_peak_only reduces robust-peak MAE from 8.87 to 5.75 m/s and improves peak bias from -7.79 to -3.17 m/s. The peak term is the strongest single intervention; high-wind weighting helps, but less than the explicit peak loss.
Model C / Stage 2 training results¶
baseline_mae_ms is the frozen Model B reference. recon_mae_ms is the sampled residual output. The probabilistic score is minimized by checkpoint selection.

The important negative result is that all refined MAEs exceed the frozen baseline (about 2.01 m/s). The current Stage 2 objective produces useful stochastic structure but does not yet deliver net pixelwise skill under this validation protocol. Structured asinh is the strongest candidate because it has the best composite score and least-negative baseline skill.
Stage 2 checkpoint evaluation¶
These are member-median summaries at guidance 1.2 over 360 observations. MSW is the literal maximum pixel; robust peak is the mean of the highest 0.5% of valid pixels.

The raw MSW and robust peak disagree: optimizing one does not optimize the other. Use robust peak, radial profiles, threshold areas, and MSW together when choosing a checkpoint.

Guidance 1.5 gives the lowest raw MSW bias/MAE, but narrows intervals and does not improve correlation. Guidance changes are not a substitute for a high-wind objective.

This bin is the clearest evidence of the failure mode: raw pixel maxima are near zero to slightly high-biased, while robust peaks are about 23--24 m/s too low. A global additive correction to the raw maximum would worsen the shape problem.
Leave-one-storm-out calibration¶

With only two storms in the LOSO folds, calibration is unstable. It can reduce raw bias, but coverage remains poor and correlations are weak. More independent storms are needed before using a calibration map operationally.
Residual-transform diagnostic¶
The initial residual q99.9 absolute tail was 18.48 m/s, with a recommended 20 m/s linear clip. After the peak/structure-aware Model B, q99.9 increased to 24.04 m/s and the data-driven clip became 25 m/s. The peak-aware baseline exposes more of the target tail; the linear transform is therefore a tail-capacity ablation, not a neutral replacement.
Recommended next model iteration¶
- Use
stage1_peak_awareorstage1_peak_onlyas the Model B baseline instead of the current balanced-sampling baseline. - Retrain
stage2_structured_asinhon that selected baseline and require non-negativemae_skill_vs_baselinebefore promotion. - Make checkpoint selection multi-objective: penalize positive literal-MSW bias and negative robust-peak bias simultaneously, while retaining radial/area constraints.
- Calibrate with more storms and storm-level folds; do not rank from the current two-storm in-sample calibration.
- Keep the K=10 ensemble for uncertainty reporting, but rank it using robust peak, high-wind-bin error, radial structure, and interval coverage together.
Post-processing follow-up¶
The completed gain/cap/median sweep is documented in Model C post-processing ablation, including corrected storm-level calibration folds and machine-readable artifact paths.
